This framework has been refined through dozens of deployments and balances speed with quality, technical rigor with business reality, and data science best practices with operational constraints.
Phase 1: Business Understanding and Scoping (2-3 Weeks)
Before writing a single line of code or touching any data, invest time understanding the business context. This phase prevents the four failure modes by grounding the entire project in operational reality.
Key Questions to Answer:
1. How do your customers make renewal decisions?
- Who are the decision-makers and influencers?
- What’s the typical decision timeline?
- When do internal discussions about renewal typically begin?
- What signals indicate a decision is being made?
2. How do your CS teams currently engage with at-risk accounts?
- What interventions do they use today?
- Which interventions are most effective?
- How long does each type of intervention take to execute?
- What’s the minimum advance notice needed for meaningful action?
3. What does your product portfolio look like?
- Which products or segments behave similarly?
- Which require distinct models?
- Are there meaningful differences in customer maturity stages?
4. Where do your teams consume model outputs?
- Do they work primarily in Salesforce? Gainsight? Excel?
- What’s their daily workflow?
- How do they currently prioritize accounts?
5. What retention models or processes exist today?
- What’s working?
- What’s not working?
- What insights from past attempts should inform this effort?
Deliverables from Phase 1:
- Required prediction timeline (e.g., “90+ days advance notice”)
- Segmentation strategy (e.g., “separate models for SMB vs. Enterprise”)
- Delivery mechanism (e.g., “integrate into existing Gainsight dashboard”)
- Success metrics (e.g., “reduce churn by 15% in high-value segment”)
- Data inventory (what’s available, what’s accessible, what’s missing)
Phase 2: Model Development and Validation (6-8 Weeks)
With business context established, this phase focuses on building predictive models through rapid iteration and close collaboration.
Week 1-2: Data Preparation and Exploration
- Start with the minimum viable dataset identified in Phase 1
- Assess data quality: completeness, consistency, accuracy
- Build comparison cohorts: matched groups of churned vs. retained accounts
- Explore initial patterns and validate with CS team domain knowledge
Week 3-5: Iterative Model Building
- Build multiple candidate models (not just one)
- Test different time horizons to find the sweet spot between accuracy and actionability
- Incorporate CS feedback on feature engineering and signal relevance

Week 6-8: Progressive Enhancement and Validation
- Layer in additional data sources identified as high-value
- Measure incremental improvement from each new data source

Key Principle: Rapid Iteration with CS Involvement
Don’t disappear for 8 weeks and emerge with a finished model. Instead, share results every 1-2 weeks:
- “Here are the top 20 accounts our initial model flags as high-risk”
- “Do these make sense based on your knowledge?”
- “What accounts are we missing?”
- “What false positives are we seeing?”
This builds trust, incorporates domain knowledge, and ensures you’re building something people will actually use.
Phase 3: Consumption Layer and Deployment (3-4 Weeks)
The final phase translates models into tools that CS teams can use in their daily workflows.
Core Requirements for the Consumption Layer:
The interface must answer three critical questions:
1. Which accounts should I prioritize?
- Ranked list of at-risk accounts
- Filterable by segment, CSM owner, risk level, account value
- Clearly marked accounts requiring immediate attention
2. Why is each account at risk?
- Primary risk drivers with contribution percentages
- Supporting evidence (usage trends, support patterns, relationship changes)
- Historical context (how has risk evolved over time?)
3. What should I do about it?
- Recommended interventions mapped to each risk driver
- Playbook links or templates for common scenarios
- Ability to document actions taken and outcomes
Implementation Approaches:
The specific implementation depends on where CS teams work:
- Dashboard integration into existing platforms (Salesforce, Gainsight, ChurnZero)
- Standalone web application for teams without a CS platform
- Automated alerts via email or Slack for accounts crossing risk thresholds
- Weekly digest reports summarizing portfolio health
The key is meeting teams where they already work rather than forcing them to adopt new tools.
Deployment Strategy:
- Start with a pilot group (2-3 CSMs covering ~50 accounts)
- Run in parallel with existing processes for 2-4 weeks
- Gather feedback and refine before broader rollout
- Expand gradually to full CS team
- Establish feedback loops for continuous improvement
Success Metrics and Continuous Improvement
Deploy the system, but don’t consider it “done.” Establish metrics to track both model performance and business impact:
Model Performance:
- Precision and recall at different risk thresholds
- False positive and false negative rates
- Model calibration (do predicted probabilities match actual outcomes?)
Business Impact:
- Churn rate changes in targeted segments
- Percentage of at-risk accounts successfully saved
- CS team adoption and usage rates
- Time saved in account prioritization
Operational Metrics:
- Average time from risk flagging to intervention
- Percentage of flagged accounts receiving intervention
- CS team satisfaction with model outputs
Use these metrics to drive continuous improvement: refining models, adjusting thresholds, adding new data sources, and evolving interventions based on what works.
